Arabic Abstract

تستكشف هذه الدراسة جدوى تطبيق تقنيات الانحدار في التعلم الآلي للتنبؤ بمعامل الدفع (C_T) ومعامل الأداء أثناء التحليق (FM) لمراوح الطائرات المسيّرة الصغيرة ذات الأقطار التي تتراوح بين 0.3 و0.4 متر. وتُستخدم البيانات التجريبية المستخرجة من قاعدة بيانات مراوح جامعة إلينوي في أوربانا-شامبين (UIUC)، والتي تم الحصول عليها من خلال اختبارات منهجية في نفق الرياح بسرعات دوران وسرعات تدفق حر متغيرة، كأساس لتطوير النموذج والتحقق من صحته. وبينما توفر التجارب التقليدية في نفق الرياح والأساليب العددية عالية الدقة، مثل برنامج ANSYS Fluent، توصيفًا ديناميكيًا هوائيًا موثوقًا، إلا أن كلا النهجين ينطوي على قيود عملية كبيرة. تتطلب الحملات التجريبية موارد ضخمة وتقتصر بطبيعتها على التكوينات المختبرة، بينما تتطلب محاكاة ديناميكيات الموائع الحسابية (CFD)، على الرغم من تقديمها فهمًا شاملًا لفيزياء تدفق المراوح، موارد حاسوبية كبيرة ووقت إعداد طويل، مما يجعل كلا النهجين غير مناسبين للفحص السريع واسع النطاق للمراوح. ولمعالجة هذه القيود، تُستخدم خوارزمية تعزيز التدرج المتطرف (XGBoost)، وهي طريقة تعلم جماعي قائمة على الأشجار، لانحدار كل من CT وFM. تم اختيار XGB لقدرتها المثبتة على استيعاب العلاقات الديناميكية الهوائية غير الخطية، ومتانتها في مواجهة القيم الشاذة، وقدرتها على دمج تنبؤات العديد من المتعلمين الضعفاء في مُقدِّر واحد عالي الدقة. تم تحسين أداء النموذج بشكل أكبر من خلال التحقق المتقاطع الخماسي وتحسين المعلمات الفائقة. تم تقييم دقة التنبؤ باستخدام جذر متوسط ​​مربع الخطأ (RMSE) ومعامل التحديد (R²). أُجريت مقارنة كمية مع الانحدار الخطي القياسي لكل من تنبؤات CT وFM لتقييم التحسينات المُقدمة في الأداء. ولزيادة التحقق من صحة المنهجية المقترحة وتوسيع نطاق تطبيقها ليشمل بيانات أخرى غير بيانات التدريب، أُجريت محاكاة ديناميكا الموائع الحسابية (CFD) على تكوين مروحة غير مُدرج في بيانات التدريب. يخدم هذا غرضين: تقييم موثوقية تنبؤات التعلم الآلي مقارنةً بالنتائج العددية عالية الدقة، وإرساء أساس متين للمرحلة اللاحقة من البحث، والتي تهدف إلى توسيع إطار التقدير ليشمل معاملات مراوح الطائرات صغيرة الحجم. تُظهر النتائج أن XGBoost يُوفر دقة تنبؤية فائقة مقارنةً بالانحدار الخطي لكلا الكميتين الديناميكيتين الهوائيتين، مما يُبرز إمكانات طرق تعزيز التدرج كبديل فعال حسابيًا وذو أساس فيزيائي للأساليب التجريبية والعددية التقليدية في التنبؤ بأداء الطائرات بدون طيار.

English Abstract

This study investigates the feasibility of applying machine learning regression techniques to predict the coefficient of thrust (CT) and the hovering figure of merit (FM) for small unmanned aerial vehicle (UAV) propellers with diameters ranging from 0.3m to 0.4 m. Experimental data extracted from the University of Illinois at Urbana-Champaign (UIUC) propeller database, obtained through systematic wind tunnel testing across varying rotational speeds and freestream velocities, serve as the foundation for model development and validation. While conventional wind tunnel experimentation and high-fidelity numerical methods such as ANSYS Fluent provide reliable aerodynamic characterization, both approaches present significant practical limitations. Experimental campaigns are resource-intensive and inherently constrained to tested configurations, whereas computational fluid dynamics (CFD) simulations, despite offering comprehensive insight into propeller flow physics, demand substantial computational resources and considerable setup time rendering either approach ill-suited for rapid, large-scale propeller screening. To address these limitations, the eXtreme Gradient Boosting (XGBoost) algorithm, a tree-based ensemble learning method, is employed for the regression of CT and FM. XGB is selected for its demonstrated capacity to capture nonlinear aerodynamic relationships, its robustness to outliers, and its ability to combine the predictions of multiple weak learners into a single high-accuracy estimator. Model performance is further enhanced through five-fold cross-validation and hyperparameter optimization. Predictive accuracy is evaluated using the root mean square error (RMSE) and the coefficient of determination (R²). A quantitative comparison against standard linear regression is conducted for both CT and FM predictions to benchmark the performance gains offered. To further validate the proposed methodology and extend its applicability beyond the training dataset, CFD simulations are performed on a propeller configuration that is not included in the training data. This serves a dual purpose: to assess the reliability of the machine-learning predictions against high-fidelity numerical results and to establish a rigorous foundation for the subsequent stage of the research, which aims to broaden the estimation framework to small-scale aircraft propeller coefficients. The results demonstrate that XGBoost provides superior predictive accuracy to linear regression for both aerodynamic quantities, highlighting the potential of gradient-boosting methods as a computationally efficient and physically grounded alternative to traditional experimental and numerical approaches for UAV performance prediction.
